Detail Description

1. Abstract

Diabetic Retinopathy Severity Classification is a deep learning project designed to classify the severity of diabetic retinopathy using retinal fundus images. Diabetic retinopathy is a diabetes-related eye condition that can damage retinal blood vessels and may lead to vision loss if not detected and managed appropriately. The proposed system uses convolutional neural networks (CNNs) and transfer learning architectures such as ResNet50, EfficientNet, or DenseNet to analyze retinal images and classify them into five severity levels: No DR, Mild, Moderate, Severe, and Proliferative DR. Image preprocessing techniques, including resizing, normalization, and data augmentation, are applied to improve model training. The system evaluates classification performance using accuracy, precision, recall, F1-score, and confusion matrices. An interactive dashboard displays uploaded retinal images, predicted severity levels, and confidence scores. The project aims to support research into automated retinal image analysis and assist screening workflows. It is an educational prototype and does not replace examination by a qualified eye-care professional.

2. Objectives

  1. To develop a deep learning model for diabetic retinopathy severity classification.
  2. To classify retinal fundus images into five severity levels.
  3. To apply transfer learning to improve image classification performance.
  4. To preprocess retinal images for effective model training.
  5. To evaluate the model using accuracy, precision, recall, and F1-score.
  6. To visualize classification results through an interactive dashboard.
  7. To support research into automated diabetic retinopathy screening.

3. Existing System

Traditional diabetic retinopathy assessment involves examining retinal fundus images by trained ophthalmologists or retinal specialists. Manual screening can be time-consuming, particularly when large numbers of patients require assessment. Basic automated systems may use conventional image-processing techniques or classification models with limited generalization across datasets.

Disadvantages of the Existing System

  1. Manual examination requires trained medical professionals.
  2. Screening large patient populations can be time-consuming.
  3. Subtle retinal abnormalities may be difficult to identify consistently.
  4. Image quality variations can affect classification.
  5. Class imbalance may reduce performance on less common severity levels.
  6. Some automated models provide limited insight into their predictions.

4. Proposed System

The proposed system uses deep learning and transfer learning to classify diabetic retinopathy severity from retinal fundus images.

Retinal images are collected from a labeled dataset, such as APTOS 2019 or EyePACS. Images are resized, normalized, and augmented where appropriate. A pretrained CNN architecture, such as EfficientNet, ResNet50, or DenseNet, is fine-tuned to classify images into the five severity categories.

The trained model generates a predicted severity level and class probabilities. An interactive Streamlit dashboard allows users to upload retinal images and view the results. Performance is assessed using class-wise metrics and a confusion matrix to identify weaknesses in classifying different severity levels. The system is intended to support research and screening evaluation, not to provide a definitive clinical diagnosis.

5. Implementation Procedure

  1. Dataset Collection: Obtain a labeled retinal fundus image dataset, such as APTOS 2019 or EyePACS.
  2. Image Preprocessing: Resize images to the selected model's input dimensions and normalize pixel values.
  3. Data Splitting: Divide the dataset into training, validation, and testing sets while preventing data leakage.
  4. Data Augmentation: Apply appropriate rotations, flips, and zoom transformations to improve training diversity.
  5. Model Selection: Select a pretrained CNN architecture, such as ResNet50, EfficientNet, or DenseNet.
  6. Transfer Learning: Replace the classification head and fine-tune the model for five-class severity classification.
  7. Model Training: Train the network using labeled retinal images and monitor validation performance.
  8. Model Evaluation: Measure accuracy, precision, recall, F1-score, and confusion matrix; examine per-class performance.
  9. Prediction Module: Develop functionality to upload a retinal image and display the predicted severity class.
  10. Dashboard Development: Build a Streamlit interface to display images, predictions, and confidence scores.
  11. Testing and Deployment: Test the model on unseen images and deploy the application locally or on a suitable hosting platform.
