Synthetic Medical Image Generation Using Diffusion Models is a deep learning project designed to generate realistic synthetic medical images using generative AI techniques. Medical image datasets often have limited samples, privacy restrictions, or insufficient representation of rare diseases, which can affect the development of medical AI models. This project uses diffusion models to learn image distributions from medical datasets and generate new synthetic images through an iterative denoising process. Medical images such as X-rays, MRI scans, or CT scans can be used depending on the selected dataset. The system preprocesses training images, trains or fine-tunes a diffusion model, and generates synthetic images from random noise. The generated images are evaluated using image quality metrics and visual inspection. An interactive dashboard allows users to generate, view, and download synthetic images. The proposed system aims to support medical imaging research and data augmentation while requiring careful validation to ensure that generated images are realistic, diverse, and do not expose sensitive patient information.
Traditional medical image datasets depend on real patient scans collected from hospitals and research institutions. Access to these datasets may be restricted by privacy requirements, while some disease categories may have limited samples. Conventional augmentation techniques such as rotation, flipping, and cropping create variations of existing images but do not generate entirely new image content.
The proposed system uses a diffusion model to generate synthetic medical images by learning the visual characteristics of a training dataset.
Initially, medical images are collected and preprocessed through resizing, normalization, and format conversion. A diffusion model learns to reverse a gradual noise-addition process, generating images by iteratively denoising random noise. Depending on available resources, the project can use a pretrained diffusion model fine-tuned on medical images or a smaller model trained from scratch.
The trained model generates synthetic images that can be inspected and evaluated for visual quality, diversity, and similarity to real data. Optional class conditioning can be added to generate images for specific dataset categories. A Streamlit dashboard provides controls for image generation and displays the generated results.
The generated images are intended for research and data augmentation. They should not be treated as real patient scans or used for clinical decisions without rigorous validation.
