Differentially Private Federated Learning is a privacy-preserving machine learning project that combines Federated Learning and Differential Privacy to protect sensitive information during collaborative model training. Traditional machine learning approaches often require centralized data collection, which can expose confidential user information. Federated Learning enables multiple clients to train models locally and share model updates instead of raw datasets. However, model updates may still reveal sensitive information. The proposed system applies Differential Privacy techniques, such as adding calibrated noise to model updates or gradients, to reduce the risk of exposing individual data records. A central server aggregates the protected updates to develop a global machine learning model. The system aims to balance data privacy and prediction performance while supporting secure and collaborative AI applications.
Traditional machine learning systems commonly collect data from multiple users and store it on a centralized server for model training. Federated Learning reduces the need for centralized data collection, but model updates may still leak information about individual training examples. Without additional privacy protection, an attacker may attempt to infer sensitive information from model updates.
The proposed system combines Federated Learning with Differential Privacy to improve the protection of sensitive data during collaborative training. Each client trains a local machine learning model using its own dataset. Before model updates or gradients are shared, the system applies privacy mechanisms such as gradient clipping and calibrated noise addition. A central server aggregates the protected updates using an algorithm such as Federated Averaging (FedAvg) to create a global model.
The system also evaluates how different privacy settings affect prediction performance, enabling users to compare privacy protection with model utility.
1. Dataset Collection: Select a suitable public dataset for a classification task, such as healthcare prediction, customer classification, or activity recognition.
2. Data Preprocessing: Handle missing values, remove duplicates, encode categorical variables, and normalize numerical features.
3. Client Simulation: Divide the dataset into separate partitions to simulate multiple independent users or organizations.
4. Local Model Development: Build a machine learning model using Scikit-learn or a neural network using PyTorch.
5. Federated Learning Setup: Use the Flower framework to coordinate local training and communication between clients and the central server.
6. Gradient Clipping: Limit the magnitude of individual contributions to reduce the influence of any single training example.
7. Noise Addition: Add calibrated random noise to gradients or updates according to the selected Differential Privacy mechanism.
8. Model Aggregation: Combine the protected client updates using FedAvg or another suitable federated aggregation algorithm.
9. Privacy Budget Management: Configure and track privacy parameters such as epsilon (ε) and delta (δ) using an appropriate privacy accounting method.
10. Performance Evaluation: Compare models trained with different privacy settings using accuracy, precision, recall, and F1-score.
11. Dashboard Development: Build a Streamlit or Flask application to display prediction results, privacy settings, and performance comparisons.
12. Testing: Evaluate the model on unseen data and analyze the relationship between privacy protection and predictive performance.
