Fairness-Aware Federated Healthcare Analytics is an AI-based healthcare project that combines Federated Learning and fairness-aware machine learning to support collaborative medical data analysis while protecting patient privacy. Healthcare datasets from different hospitals may contain variations in patient populations, demographics, and disease distributions, which can lead to biased predictions and unequal model performance across groups. Traditional centralized systems require medical data to be collected in a central location, raising privacy and security concerns. The proposed system enables hospitals to train local machine learning models and share model updates without directly transferring raw patient records. It incorporates fairness evaluation techniques to identify performance disparities across demographic groups and supports strategies to reduce bias in the global model. The system aims to improve privacy-aware healthcare analytics while promoting more equitable and reliable disease prediction.
Existing healthcare analytics systems commonly use centralized machine learning models trained on combined patient datasets. These models may learn biases from imbalanced or unrepresentative data, resulting in different prediction performance across demographic groups. Standard Federated Learning reduces the need for centralized data collection but does not automatically address fairness issues between hospitals or patient populations.
The proposed system combines Federated Learning with fairness-aware evaluation and bias mitigation techniques. Each hospital trains a local disease prediction model using its own medical dataset. The server aggregates compatible model updates to build a global model without directly collecting raw patient records.
The system evaluates predictive performance across selected demographic groups using fairness metrics such as demographic parity difference, equal opportunity difference, and group-level recall. Depending on the results, suitable techniques such as reweighting, threshold adjustment, or fairness-aware training can be applied to reduce disparities.
1. Dataset Collection: Obtain a suitable public healthcare dataset for a task such as diabetes or heart disease prediction, with appropriate demographic attributes for fairness evaluation.
2. Data Preprocessing: Handle missing values, remove duplicates, encode categorical features, and normalize numerical variables.
3. Hospital Client Simulation: Partition the dataset into multiple clients representing hospitals with different patient populations and data distributions.
4. Local Model Development: Train a machine learning model, such as Logistic Regression, Random Forest, or a neural network, at each client.
5. Federated Learning Setup: Use Flower to coordinate local model training and communication with a central aggregation server.
6. Global Model Aggregation: Apply Federated Averaging (FedAvg) or another suitable aggregation method to combine compatible local model updates.
7. Fairness Metric Selection: Define protected or demographic groups and select suitable fairness metrics, such as demographic parity difference, equal opportunity difference, and group-level recall.
8. Fairness Evaluation: Evaluate model performance and fairness indicators across demographic groups and participating hospitals.
9. Bias Mitigation: Apply an appropriate method, such as sample reweighting or threshold adjustment, and evaluate its impact on accuracy and fairness.
10. Performance Comparison: Compare the baseline and fairness-aware models using accuracy, precision, recall, F1-score, and selected fairness metrics.
11. Dashboard Development: Build a Streamlit or Flask interface to display disease predictions, performance metrics, and group-level fairness results.
12. Testing: Test the system with different client distributions and verify that fairness improvements do not create unacceptable losses in overall predictive performance.
