Secure Aggregation for Federated Learning is a privacy-preserving machine learning project designed to protect client model updates during collaborative training. In traditional federated learning, multiple clients train models locally and send their updates to a central server for aggregation. However, individual model updates may reveal sensitive information about local training data. The proposed system integrates secure aggregation techniques that allow the server to combine model updates without accessing each client's individual contribution in plaintext. The aggregated updates are used to generate a global model using Federated Averaging (FedAvg). This approach improves confidentiality during distributed training and supports collaborative AI applications in healthcare, finance, IoT, and other sensitive-data environments.
In conventional federated learning, clients train models locally and transmit their model updates to a central server. Although raw datasets remain on individual clients, the server can typically access each submitted update. These updates may expose information about the training data, creating privacy risks if the server is compromised or behaves maliciously.
The proposed system incorporates Secure Aggregation into a federated learning framework. Each client trains a local model and protects its model update using a secure aggregation protocol. The central server receives protected contributions and computes the combined update without directly viewing individual updates in plaintext.
The aggregated update is used to update the global model, which is then distributed to participating clients for subsequent training rounds. The project can demonstrate secure aggregation through a cryptographic protocol or a suitable framework implementation.
1. Dataset Collection: Select a public dataset for a classification task, such as healthcare prediction, activity recognition, or image classification.
2. Data Preprocessing: Handle missing values, remove duplicates, encode categorical variables, and normalize numerical features.
3. Client Simulation: Divide the dataset into separate partitions representing independent clients.
4. Local Model Development: Build a machine learning model using Scikit-learn or a neural network using PyTorch or TensorFlow.
5. Federated Learning Setup: Use Flower to coordinate local model training and communication between clients and the server.
6. Baseline Training: Implement standard Federated Learning using Federated Averaging and record model performance.
7. Secure Aggregation Configuration: Implement or configure a supported secure aggregation protocol to protect client updates.
8. Protected Update Exchange: Have clients submit cryptographically protected updates instead of exposing individual contributions in plaintext.
9. Secure Aggregation: Combine the protected client updates according to the selected protocol and recover only the permitted aggregate.
10. Global Model Update: Apply the aggregated result to update the global model and distribute it to participating clients.
11. Performance Evaluation: Compare accuracy, training time, communication overhead, and aggregation performance against the baseline.
12. Dashboard Development: Build a Streamlit or Flask application to display training rounds, participating clients, accuracy, and aggregation status.
13. Security Testing: Verify that individual updates are not exposed through the intended server workflow and test the protocol under supported client dropout conditions.
