Multimodal Pest Outbreak Prediction is an AI-based agricultural project that combines multiple data sources, including weather conditions, crop images, soil characteristics, and historical pest records, to predict potential pest outbreaks. Traditional pest monitoring methods often depend on manual field inspections and historical observations, which may delay the identification of emerging pest threats. The proposed system integrates machine learning, deep learning, and multimodal data analysis to identify patterns associated with pest activity. Weather parameters such as temperature, humidity, and rainfall are combined with crop image features and historical infestation data to estimate pest risk levels. The system generates risk classifications and visual alerts through an interactive dashboard, helping farmers take preventive measures and improve crop protection. This project aims to support early pest risk identification, reduce crop losses, and promote data-driven agricultural management.
Traditional pest monitoring relies on manual field inspections, farmer observations, pest traps, and historical agricultural records. Although these methods provide useful information, they may not identify emerging pest outbreaks quickly enough. Some existing prediction systems use weather data or image classification separately, limiting their ability to combine different sources of information for more comprehensive risk assessment.
The proposed system combines multimodal machine learning with deep learning to analyze agricultural information from multiple sources. Weather data and historical pest records are processed to identify environmental patterns, while crop images are analyzed using computer vision to detect visible pests or symptoms.
The extracted image features are combined with weather and historical data to estimate pest outbreak risk. A machine learning model classifies the risk level and displays results through a dashboard. The system can also generate alerts when predicted risk exceeds a defined threshold.
1. Dataset Collection: Collect historical pest occurrence records, weather data, crop images, and relevant agricultural information from public datasets or reliable sources.
2. Data Preprocessing: Handle missing values, remove duplicate records, normalize numerical features, and standardize date and location information.
3. Image Preprocessing: Resize crop images, normalize pixel values, and label images with the appropriate pest or symptom categories.
4. Weather Feature Extraction: Extract relevant environmental features, including temperature, humidity, rainfall, and other available weather indicators.
5. Image Model Development: Train a CNN or use transfer learning with a model such as MobileNetV2 or ResNet50 to identify visible pests or crop symptoms.
6. Tabular Model Development: Train a machine learning model such as Random Forest, XGBoost, or Logistic Regression using weather and historical pest records.
7. Multimodal Feature Fusion: Combine image features with weather and historical information using feature-level fusion or a suitable late-fusion strategy.
8. Risk Prediction: Train the combined model to classify pest outbreak risk based on labeled historical observations.
9. Model Evaluation: Evaluate the model using precision, recall, F1-score, confusion matrices, and suitable warning performance metrics.
10. Alert Generation: Configure risk thresholds to display alerts when predicted pest risk reaches a predefined level.
11. Dashboard Development: Build a Streamlit or Flask interface to display crop images, environmental conditions, pest predictions, and risk levels.
12. Testing: Test the model on unseen data and, where possible, evaluate performance across different seasons, locations, and crop varieties.
